Transfer learning allows knowledge gained in one domain (pretrained model) to be adapted to new domains (specific tasks). This enables high accuracy on tasks not originally trained for, by applying and refining pretrained knowledge. It accelerates deployment and reduces computational cost.
Practitioners optimize this process by determining which layers of the pretrained model to freeze (preserving learned features) and which to retrain to suit the specific requirements of the new task. Lower layers capturing universal patterns may remain untouched while more task-specific upper layers are fine-tuned or replaced.
Transfer learning differs from traditional supervised learning, which trains models from scratch on a specific dataset requiring extensive labeled data and computational resources. In reinforcement learning, an agent learns optimal behavior through trial-and-error interactions; transfer learning capitalizes on existing patterns from unrelated or semi-related tasks. Unsupervised learning focuses on discovering hidden structures in unlabeled data, while transfer learning fine-tunes pretrained models for specific goals. Transfer learning is advantageous for domains with limited data, reducing computational cost and data requirements while preserving high quality.
Real-world example: Medical imaging. Diagnosing diseases through imaging (e.g., detecting tumors in MRI scans) often requires highly accurate models trained on specialized data. Using transfer learning, practitioners start with a pretrained CNN like ResNet trained on millions of general images. By fine-tuning ResNet on a smaller dataset of labeled MRI scans, the model can identify tumors with high precision. This saves time and achieves exceptional accuracy, enabling faster deployment of AI-driven diagnostic tools.
